I Lost $17,000 in Crypto. Here’s How to Avoid My Mistake

In 2014, I bought 25,000 dogecoin as a joke. By 2021, it was briefly worth over $17,000. Problem was, I couldn’t remember the password. Determined to get my coins back, I embarked on a journey that exposed me to online hackers, the mathematics behind passwords, and a lot of frustration.

Although most people don’t have thousands in forgotten cryptocurrency, everyone relies on passwords to manage their digital lives. And as more and more people buy crypto, how can they protect their assets? We talked to a host of experts to figure out how to create the best passwords for your digital accounts, and, if you have crypto, what your basic storage tradeoffs are. Let’s dive in.

How to Hack Your Own Crypto Wallet

There are a few common ways to lose crypto. You might have a wallet on a hard drive you throw away. Your exchange could get hacked. You might lose your password, or you might get personally hacked and have your coins stolen. For those who lose their password, as I did, hackers actually present a silver lining. If you still control your wallet, you can try to hack your own wallet—or find someone who will.

So I contacted Dave Bitcoin, an anonymous hacker famous for cracking crypto wallets. He agreed to help break into the wallet, for his standard 20 percent fee—paid only if he is successful. Dave and other hackers are mostly using brute force techniques. Basically, they’re just guessing passwords—a lot of them.

You can also try to hack your own wallet with apps like Pywallet or Jack the Ripper. But I didn’t want to do it myself, so I sent Dave a list of password possibilities and he got started.

After a little waiting, I received an email from Dave. “I tried over 100 billion passwords on your wallet,” Dave told me over email. I assumed such a mind-boggling amount of tries meant my coins were surely recovered, but alas, we had only scratched the surface. The password was not hacked, and my coins remained lost. But how?

The Math Behind Strong Passwords

Each new digit in a password makes it exponentially harder to crack. Consider a one-digit password that could be a letter or a number. If the password is case-sensitive, there are 52 letters plus 10 numerals. Not very secure. You could simply guess the password by trying 62 times. (A, a, B, b, C, c … and so on).

Now make it a two-digit password. It doesn’t get twice as hard to guess—it gets 62 times harder to guess. There are now 3884 possible passwords to guess (AA, Aa, AB, etc.) A six-digit password with the same rules has around 56 billion possible permutations, assuming we don’t use special characters. A 20-character password with those rules has 62-to-the-20th-power permutations: that is, ​​704,423,425,546,998,022,968,330,264,616,370,176 possible passwords. That makes 100 billion look pretty small in comparison.

This math was bad news for me, since I’m pretty sure I had some sort of long password, like a few lines of a song lyric. Talk about facing the music.

Password Best Practices

Whether it’s for your email or crypto wallet, how can you balance creating a strong password that’s also memorable? “Choosing passwords is tricky,” says Dave, “If you go out of your way to create an unusual password for your wallet that you wouldn’t typically use, then it makes it quite difficult for you to remember and for me to help.

It’s easier to guess your password if you use consistent patterns. Of course, this is bad for security, and someone who is trying to hack your accounts will have an easier time.” Balancing security with memorability is ultimately a tough task that will depend on the individual’s needs and preferences.

“All I can really suggest is to either record all your passwords on paper (and take the risk that it will be found), or use a password manager,” Dave says. Ironically, the digital age is now making pen and paper a preferred security method. Russia’s state security agency supposedly reverted to typewriters after the Snowden leaks.

Are Coins on Crypto Exchanges Safe?

Losing my password made me a pretty big fan of storing crypto on exchanges. After all, if you forget your Coinbase password, the process is simple. You reset your password, and likely submit identification to verify that you own the account. On the surface, storing on big exchanges seems pretty secure.

Coinbase says they keep “over 98 percent of deposits offline in secure cold storage facilities” in addition to having an “extensive insurance policy.” Thus, it should be difficult or impossible for cybercriminals to access most of the crypto Coinbase controls.

Gemini, another popular US-based exchange, prides itself on its seemingly extensive security measures. At the same time, if your exchange suffers a major hack or goes bankrupt, it could take years to recover your crypto, if you get it back at all. The body of knowledge and practice known as mathematics is derived from the contributions of thinkers throughout the ages and across the globe. It gives us a way to understand patterns, to quantify relationships, and to predict the future. Math helps us understand the world — and we use the world to understand math.

The world is interconnected. Everyday math shows these connections and possibilities. The earlier young learners can put these skills to practice, the more likely we will remain an innovation society and economy. Algebra can explain how quickly water becomes contaminated and how many people in a third-world country drinking that water might become sickened on a yearly basis. A study of geometry can explain the science behind architecture throughout the world.

Statistics and probability can estimate death tolls from earthquakes, conflicts and other calamities around the world. It can also predict profits, how ideas spread, and how previously endangered animals might repopulate. Math is a powerful tool for global understanding and communication. Using it, students can make sense of the world and solve complex and real problems. Rethinking math in a global context offers students a twist on the typical content that makes the math itself more applicable and meaningful for students.

For students to function in a global context, math content needs to help them get to global competence, which is understanding different perspectives and world conditions, recognizing that issues are interconnected across the globe, as well as communicating and acting in appropriate ways. In math, this means reconsidering the typical content in atypical ways, and showing students how the world consists of situations, events and phenomena that can be sorted out using the right math tools.

Any global contexts used in math should add to an understanding of the math, as well as the world. To do that, teachers should stay focused on teaching good, sound, rigorous and appropriate math content and use global examples that work. For instance, learners will find little relevance in solving a word problem in Europe using kilometers instead of miles when instruments already convert the numbers easily. It doesn’t contribute to a complex understanding of the world.

Math is often studied as a pure science, but is typically applied to other disciplines, extending well beyond physics and engineering. For instance, studying exponential growth and decay (the rate at which things grow and die) within the context of population growth, the spread of disease, or water contamination, is meaningful. It not only gives students a real-world context in which to use the math, but helps them understand global phenomena –

They may hear about a disease spreading in India, but can’t make the connection without understanding how fast something like cholera can spread in a dense population. In fact, adding a study of growth and decay to lower level algebra – it’s most often found in algebra II – may give more students a chance to study it in the global context than if it’s reserved for the upper level math that not all students take.

In a similar vein, a study of statistics and probability is key to understanding many of the events of the world, and is usually reserved for students at a higher level of math, if it gets any study in high school at all. But many world events and phenomena are unpredictable and can only be described using statistical models, so a globally focused math program needs to consider including statistics.

Probability and statistics can be used to estimate death tolls from natural disasters, such as earthquakes and tsunamis; the amount of aid that might be necessary to help in the aftermath; and the number people who would be displaced. Understanding the world also means appreciating the contributions of other cultures. In algebra, students could benefit from studying numbers systems that are rooted in other cultures, such the Mayan and Babylonian systems, a base 20 and base 60 system, respectively.

They gave us elements that still work in current math systems, such as the 360 degrees in a circle, and the division of the hour into 60 minute intervals, and including this type of content can help develop an appreciation for the contributions other cultures have made to our understanding of math.

How to Fix The Minority STEM Crisis

Boasting a stellar academic record, a bachelor’s degree in engineering, and an MBA, Carla landed a plum job at one of the nation’s leading computer and information technology companies. She was excited to join the tech world and contribute to the Texas-based company where she hoped to make her career.

Carla’s excitement didn’t last. A Black woman, she felt overlooked and excluded from opportunities to advance. She found herself fighting for her annual raise. “I honestly felt,” she said, “like it was because I was a woman. I had probably one other woman on my team at various times, and it just seemed like the men weren’t having the same problems we were having …

I felt like at some point they weren’t listening to me.” After being asked to clean out the office of a colleague who had left the firm, she came across one of his old pay stubs. She discovered that he’d been making four times her salary despite having just one more year of experience. She abandoned her dream of working in technology and now works as a human resources officer for a law firm.

Carla’s story is one of 25 qualitative interviews at the core of a new report, STEM Voices: The Experiences of Women and Minorities in Science, Technology, Engineering and Math Occupations, published by the American Enterprise Institute (AEI). (Subjects spoke to us on condition of anonymity.) Carla’s account—and others—echoes many of the themes discovered in an earlier AEI survey of STEM worker perspectives, which identified sharp differences in perception about workplace environment, support, and opportunities.

In that survey, conducted in 2020, white and Asian men saw the workplace as collaborative, open, and friendly and believed that women and minorities experienced their jobs in similar ways. Female and minority respondents said quite the opposite: They felt overlooked, not included as teammates, and cut off from the kind of coworker support their white and Asian male coworkers said they enjoyed. The survey data showed two almost entirely different worlds.

For STEM Voices, we tracked down 21 participants from the 2020 survey to paint a clearer picture of the people behind the survey data (interviews with a handful of other STEM professionals supplemented this research).

Our findings help explain why diversity remains elusive in STEM: Diversity, equity, and inclusion initiatives (DEI) can get workers to the foot of the ladder, but they don’t help them climb.

Despite myriad recruitment programs and initiatives to boost the number of women and minorities pursuing science and tech careers, women make up just 34 percent of the STEM workforce, according to the National Science Foundation. At the same time, Black and Hispanic Americans are underrepresented, especially among workers with a bachelor’s degree or more.To be clear, the problems for women and minorities in STEM start well before employment and even before graduation from post-secondary institutions.

One reason for these failures is a faulty “pipeline” of female and minority students into STEM. Blacks and Hispanics, for instance, are less likely to attend college, major in STEM, or complete a degree than whites. In 2017–19, Black and Hispanic students earned just 7 percent and 12 percent of STEM bachelor’s degrees, respectively, according to the Pew Research Center, though they collectively represent 31 percent of the U.S. population. But as Stem Voices reveals, the pipeline isn’t the only problem. Our interviews delved deeply into workers’ personal and career trajectories to understand their experiences and the challenges they faced on the job.

Over and over, female and minority workers recalled confronting barriers to success, including social isolation, lack of mentors, and outright discrimination. Though STEM careers might be among the most lucrative and in demand in today’s economy, many of the female and minority workers we interviewed did not believe that those opportunities were available to them.Many said they felt shut out from opportunities for advancement and lamented the lack of supervisors and mentors who looked like them.

As the computer instructor Michelle P. told us, “I never had a female manager. Ever.” A majority of women and workers of color interviewed also said they had experienced some sort of stereotyping, discrimination, or bias because of their race or gender. Out of 19 female and nonwhite interviewees, only two said they had never personally experienced discrimination or disparate treatment.

Many reported hurtful comments based on stereotypes about their intelligence or capabilities, which affected their morale, performance, and perceptions about their field. Others said they were passed over for promotions and other opportunities. John D., a Black computer programmer, said he overheard colleagues at his firm say they “had to overlook qualified white people to hire unqualified Black people.”

Tiffany C., an Asian doctoral student, said she was labeled as “difficult to work with” at the engineering design firm in Austin, Texas, where she worked before returning to graduate school. Carla A., the engineer, was told she needed “to smile more.” Another interviewee said one of her supervisors micromanaged her work but not those of lesser-qualified whites. “There is some sort of preconceived notion that Black people don’t do well in sciences,” J.S., who holds a doctorate in veterinary science and works for the federal government, said.

Many interviewees said they confronted unwelcoming office cultures and that they struggled to fit in. Women with children said balancing work and family obligations was a particular challenge, while other women said they kept to themselves to avoid sexual harassment. “One of the things … I kind of learned early on, too … was to really make clear that … I was happily married and not looking for anything,” said the IT instructor Michelle P. David B., a Black engineer, said he felt the need to seem unthreatening to white colleagues and bosses at the naval shipyard where he worked.

“I had to downplay the fact that I went to a good engineering school,” he told us. “As a matter of fact, I had to downplay that I even had an engineering degree, and I was going for a master’s degree.” Compounding these issues are the vastly different perceptions alluded to above, held by white workers in STEM. According to our July 2020 survey of STEM degree holders, more than 50 percent of women and nonwhite STEM workers said they believe that women and minorities encounter more obstacles in STEM than in other industries.

AEI’s 2020 survey also found, however, that many white workers don’t agree that their female and minority colleagues face difficulties in advancement, which perhaps presents the thorniest challenge to improving diversity in STEM. To these white workers, there is no problem to fix. Just 26 percent of whites in AEI’s previous survey, for instance, thought Black workers face more obstacles in STEM than in other fields compared to 51 percent of nonwhite workers.

While only 34 percent of men said women face more hurdles to advancement, 54 percent of women said they did. The white men we interviewed for STEM Voices also reflected these sentiments. “I didn’t see people, females, and the few minorities that were there held back,” said the retired chemist Jack H., who spent his career in the Army and is white. “If you have the ability and the drive, people will see that.” Moreover, some interviewees, such as the wildlife biologist Todd B., said they believed that concerns about racism and sexism are overblown.

“When you have a fire and you let the fire burn down to nothing but an ember, when you start blowing on that ember, it’s going to break out into a flame again,” he said. “My opinion is if we stopped focusing on all the racism … if we just let it die down, it would eventually go away.” This chasm in perceptions between white male workers on the one hand and their female and minority colleagues on the other means that STEM’s diversity crisis defies an easy fix. Culture, moreover, is notoriously difficult to change through policy.

This is something of a tautology: One of the best ways to solve the STEM diversity problem is simply to increase the number of women and minorities in the sector. To do that, we need complementary strategies that boost the numbers of women and minorities in the STEM pipeline and “stop-loss” efforts focused on retaining those already in the field who can strengthen diversity and inclusion efforts on the job and provide more mentors for those in the pipeline.

Historically black colleges and universities play a crucial role in building the pipeline. Many of the interviewees in STEM Voices, for instance, attended an HBCU, where they had mentors, felt challenged in their courses, and belonged to a community. These foundational experiences, interviewees said, instilled the confidence and self-reliance they’ve needed to survive in challenging work environments.

One obvious step, therefore, is to increase investment in HBCUs, which produce a disproportionate share of the nation’s Black STEM graduates. Nearly half of the Black women who earned degrees in STEM between 1995 and 2004 graduated from an HBCU. Although the American Rescue Plan granted HBCUs a historic $2.7 billion, this much-needed infusion didn’t reverse decades of chronic underfunding.

Another pipeline strategy is to dramatically increase the number of Black and Hispanic K–12 teachers in STEM. Just 6 percent of K–12 STEM teachers in 2012 were Black, and only 6 percent were Hispanic, according to research by Tuan Nguyen of Kansas State University and Christopher Redding of the University of Florida. Increasing the number of minority teachers in STEM would provide more minority students with the role models and mentors that many of our interviewees said were critical to their decision to major in STEM fields in college.

Expanding internships and early work experience would also allow minority students to develop mentors and professional networks for future guidance and support. The retention challenge is rooted more in culture than in formal education and is, therefore, harder to address. The answer is not, however, more “diversity training.” As Frank Dobbin of Harvard University and Alexandra Kalev of Tel Aviv University write, these efforts can backfire because “anti-bias messaging tends to provoke resistance in white men who feel unjustly accused of discrimination or worry that their employers’ commitment to equity threatens their careers.”

Most of the disadvantage women and minorities experience is subconscious and unintentional, rather than overtly racist or sexist. This accounts for the wildly different interpretations of working conditions and opportunities we discovered in the survey and STEM Voices. Everyone understands the awkwardness and discomfort of being outnumbered in a social setting. Alerting managers and employees to “go the extra mile” to ensure that women and minorities are integrated into day-to-day work will do much to break down barriers.

As Dobbin and Kalev suggest, managing diversity should not be “relegated” to women and workers of color but be part of every manager’s job description. Over time, structural investments and human resource efforts like these will produce the numbers of women and minority professionals necessary to shift the culture of STEM for the better. In the interim, those in positions of authority and advantage in the workplace need to redouble their efforts to build resilient workers who can succeed despite the odds against them.

The Online Data That’s Being Deleted

For years, we were encouraged to store our data online. But it’s become increasingly clear that this won’t last forever – and now the race is on to stop our memories being deleted. How would you adjust your efforts to preserve digital data that belongs to you – emails, text messages, photos and documents – if you knew it would soon get wiped in a series of devastating electrical storms?

That’s the future catastrophe imagined by Susan Donovan, a high school teacher and science fiction writer based in New York. In her self-published story New York Hypogeographies, she describes a future in which vast amounts of data get deleted thanks to electrical disturbances in the year 2250.

In the years afterwards, archaeologists comb through ruined city apartments looking for artefacts from the past – the early 2000s.

“I was thinking about, ‘How would it change people going through an event where all of your digital stuff is just gone?’” she says.

In her story, the catastrophic data loss is not a world-ending event. But it is a hugely disruptive one. And it prompts a change in how people preserve important data. The storms bring a renaissance of printing, Donovan writes. But people are also left wondering how to store things that can’t be printed – augmented reality games, for instance.

Data has never been completely safe from obliteration. Just consider the burning of the Great Library of Alexandria – its very destruction is possibly the only reason you’ve heard about it. Digital data does not disappear in huge conflagrations, but rather with a single click or the silent, insidious degradation of storage media over time.

Today, we’re becoming accustomed to such deletions. There are lots of examples – the MySpace profiles that famously vanished in 2019. Or the many Google services that have shut down over the years. And then there are the online data storage companies that have offered to keep people’s data safe for them. Ironically, they have sometimes ended up earmarking it for deletion.

In other cases, these services actually keep running for long periods. But users might lose their login details. Or forget, even, that they had an account in the first place. They’ll probably never find the data stored there again, like they might find a shoebox of old letters in the attic.

Donovan’s interest in the ephemerality of digital data stems from her personal experiences. She studied maths at university and has copies of her handwritten notes. “There’s a point when I started taking digital notes and I can’t find them,” she says with a laugh.

She also had an online diary that she kept in the late 1990s. It’s completely lost now. And she worked on creative projects that no longer survive intact online. When she made them, it felt like she was creating something solid. A film that could be replayed endlessly, for instance. But now her understanding of what digital data is, and how long it might last, has changed.

“It was more like I produced a play, and you got to watch it, and then you just have your memories,” she says.

Thanks to the permanence of stone tablets, ancient books and messages carved into the very walls of buildings by our ancestors, there’s a bias in our culture towards assuming that the written word is by definition enduring. We quote remarks made centuries ago often because someone wrote them down – and kept the copies safe. But in digital form, the written word is little more than a projection of light onto a screen. As soon as the light goes out, it might not come back.

That said, some online data lasts a very long time. There are several examples of websites that are 30 years old or more. And now and again data hangs around even when we don’t want it to. Hence the emergence of the “right to be forgotten”. As tech writer and BBC web product manager Simon Pitt writes in the technology and science publication OneZero, “The reality is that things you want will disappear and things you don’t will be around for forever.”

Someone who aims to redress this balance is Jason Scott. He runs Archive Team, a group dedicated to preserving data, especially from websites that get shut down.

He has presided over dozens of efforts to capture and store information in the nick of time. But often it’s not possible to save everything. When MySpace accidentally deleted an estimated 50 million songs that were once held by the social network, an anonymous academic group gave Archive Team a collection of nearly half a million tracks they had previously backed up.

“There were bands for whom MySpace was their only presence,” says Scott. “This entire cultural library got wiped out.”

MySpace apologised for the data loss at the time.

“Once you delete the stuff it just disappears utterly,” says Scott, explaining the significance of proactive efforts to preserve data. He also argues that society has, to an extent, sleepwalked into this situation: “We did not expect the online world was going to be as important as it was.”

It should be clear by now that digital data is, at best, slippery. But how to curb its habit of disappearing?

Scott says he thinks there should be legal or regulatory requirements on companies that give people the option to retrieve their data, for a certain period – say, five years – after an online service is due to shut down. Within that time, anyone who wants their information could download it, or at least pay for a CD copy of it to be sent to them.

A small number of companies have set a good example, he adds. Scott points to Glitch, a 2D online multiplayer game that was removed from the web in 2012, just over a year after it was launched. Its liquidation, in data terms, was “basically perfect”, says Scott. Others, too, have praised the fact that the game’s developers acknowledged players’ frustrations and gave them ample opportunity to download their data from the company’s servers before they were switched off.

Some of the game’s code was even made public and multiple remakes of Glitch, developed by fans, have emerged in the years since. Should this approach be mandatory, though?

“We should have real-time rights, for example to ask for data deletion, data download, or data portability – to take the data from one source to another,” argues Teemu Ropponen at MyData.

He and his colleagues are working on systems designed to make it easier for people to transfer important data about themselves, such as their family history or CV, between services or institutions.

Ropponen argues that there are efforts within the European Union to enshrine this sort of data portability in law. But there is a long way to go.

Even if the technology and regulations were in place, that doesn’t mean that preserving data would become easy overnight. We have so much of it that it is actually quite hard to fathom.

Around 150 years ago, making a photograph of a family member was a luxury available only to the wealthiest in society. For decades, this more or less remained the case. Even when the technology became more broadly available, it wasn’t cheap to take lots of snaps at once. Photographs became treasured items as a result. Today, smartphone cameras mean it feels like second nature to take literally hundreds or even thousands of photographs every year.

Royster argues that saving all of our data won’t necessarily be very useful to our descendants. And he disagrees with Scott and Ropponen that laws are the answer. Governments and legislators are often behind the curve on technology issues and sometimes don’t understand the systems they intend to regulate, he says.

Instead, people ought to get into the habit of selecting and preserving the data that is most important to them. “We should set aside one day of the year when we all go through our data – data preservation day,” he says.

Scott also suggests that we should think about what we really want to keep, just in case it gets deleted. “Nobody is thinking of it as the stuff that we have to preserve at all costs, it’s just more data,” he says. “If it’s written, I would print it out.”

There is another option, though. Miia Kosonen at South-Eastern Finland University of Applied Sciences and her colleagues have been working on solutions for storing digital data in archives and national institutions.

“We converted more than 200,000 old emails from former chief editors of Helsingin Sanomat – the largest newspaper in Finland,” she says, referring to a pilot project by Digitalia, a digital data preservation project. The converted emails were later stored in a digital archive.

The US Library of Congress famously keeps a digital archive of tweets, though it has stopped recording every single public tweet and is now preserving them “on a very selective basis” instead.

Could public institutions do some digital data curation and preservation on our behalf? If so, we could potentially submit information to them such as family history and photographs for storage and subsequent access in the future.

Kosonen says that such projects would naturally require funding, probably from the public. Institutions would also be more inclined to retain information that is considered of significant cultural or historical interest.

At the heart of this discussion lies a simple fact: it’s hard for us to know – here in the present – what we, or our descendants, will actually value in the future.

Archival or regulatory interventions could go some way to addressing the ephemerality of data. But that ephemerality is something we will probably always live with, to some extent. Digital data is just too convenient for everyday purposes and there’s little rationale for trying to store everything.

The question has become, at best, one of personal motivation. Today, we decide either to make or not make the effort to save things. Really save them. Not just on the nearest hard-drive or cloud storage device. But also to backup drives or more permanent media, with instructions for how to maintain the storage over time.

This might sound like an exceptionally dry endeavour, but it need not be. A cultural movement might be all it takes to spur us on.

Many audiophiles insist on buying vinyl in an age of music streaming. Booklovers still make the effort to acquire physical copies of their favourite author’s new work. Perhaps we need an analogue-cool movement for preservationists. People who devote themselves to making physical photo albums again. Who go out of their way to write handwritten notes or letters.

These things might just end up being far easier to keep than anything digital, which will likely always require you to trust a system you haven’t built, or a service you don’t own. As Donovan says, “If something is precious, it’s dangerous, I think, to leave it in someone else’s hands.”

6 Math Foundations to Start Learning Machine Learning

As a Data Scientist, machine learning is our arsenal to do our job. I am pretty sure in this modern times, everyone who is employed as a Data Scientist would use machine learning to analyze their data to produce valuable patterns. Although, why we need to learn math for machine learning? There is some argument I could give, this includes:

  • Math helps you select the correct machine learning algorithm. Understanding math gives you insight into how the model works, including choosing the right model parameter and the validation strategies.
  • Estimating how confident we are with the model result by producing the right confidence interval and uncertainty measurements needs an understanding of math.
  • The right model would consider many aspects such as metrics, training time, model complexity, number of parameters, and number of features which need math to understand all of these aspects.
  • You could develop a customized model that fits your own problem by knowing the machine learning model’s math.

The main problem is what math subject you need to understand machine learning? Math is a vast field, after all. That is why in this article, I want to outline the math subject you need for machine learning and a few important point to starting learning those subjects.

Machine Learning Math

We could learn many topics from the math subject, but if we want to focus on the math used in machine learning, we need to specify it. In this case, I like to use the necessary math references explained in the Machine Learning Math book by M. P. Deisenroth, A. A. Faisal, and C. S. Ong, 2021.

In their book, there are math foundations that are important for Machine Learning. The math subject is:

Six math subjects become the foundation for machine learning. Each subject is intertwined to develop our machine learning model and reach the “best” model for generalizing the dataset.

Let’s dive deeper for each subject to know what they are.

Linear Algebra

What is Linear Algebra? This is a branch of mathematic that concerns the study of the vectors and certain rules to manipulate the vector. When we are formalizing intuitive concepts, the common approach is to construct a set of objects (symbols) and a set of rules to manipulate these objects. This is what we knew as algebra.

If we talk about Linear Algebra in machine learning, it is defined as the part of mathematics that uses vector space and matrices to represent linear equations.

When talking about vectors, people might flashback to their high school study regarding the vector with direction, just like the image below.

This is a vector, but not the kind of vector discussed in the Linear Algebra for Machine Learning. Instead, it would be this image below we would talk about.

What we had above is also a Vector, but another kind of vector. You might be familiar with matrix form (the image below). The vector is a matrix with only 1 column, which is known as a column vector. In other words, we can think of a matrix as a group of column vectors or row vectors. In summary, vectors are special objects that can be added together and multiplied by scalars to produce another object of the same kind. We could have various objects called vectors.

Linear algebra itself s a systematic representation of data that computers can understand, and all the operations in linear algebra are systematic rules. That is why in modern time machine learning, Linear algebra is an important study.

An example of how linear algebra is used is in the linear equation. Linear algebra is a tool used in the Linear Equation because so many problems could be presented systematically in a Linear way. The typical Linear equation is presented in the form below.

To solve the linear equation problem above, we use Linear Algebra to present the linear equation in a systematical representation. This way, we could use the matrix characterization to look for the most optimal solution.

To summary the Linear Algebra subject, there are three terms you might want to learn more as a starting point within this subject:

  • Vector
  • Matrix
  • Linear Equation

Analytic Geometry (Coordinate Geometry)

Analytic geometry is a study in which we learn the data (point) position using an ordered pair of coordinates. This study is concerned with defining and representing geometrical shapes numerically and extracting numerical information from the shapes numerical definitions and representations. We project the data into the plane in a simpler term, and we receive numerical information from there.

Above is an example of how we acquired information from the data point by projecting the dataset into the plane. How we acquire the information from this representation is the heart of Analytical Geometry. To help you start learning this subject, here are some important terms you might need.

  • Distance Function

A distance function is a function that provides numerical information for the distance between the elements of a set. If the distance is zero, then elements are equivalent. Else, they are different from each other.

  • Inner Product

The inner product is a concept that introduces intuitive geometrical concepts, such as the length of a vector and the angle or distance between two vectors. It is often denoted as ⟨x,y⟩ (or occasionally (x,y) or ⟨x|y⟩).

Matrix Decomposition

Matrix Decomposition is a study that concerning the way to reducing a matrix into its constituent parts. Matrix Decomposition aims to simplify more complex matrix operations on the decomposed matrix rather than on its original matrix.

A common analogy for matrix decomposition is like factoring numbers, such as factoring 8 into 2 x 4. This is why matrix decomposition is synonymical to matrix factorization. There are many ways to decompose a matrix, so there is a range of different matrix decomposition techniques. An example is the LU Decomposition in the image below.

Vector Calculus

Calculus is a mathematical study that concern with continuous change, which mainly consists of functions and limits. Vector calculus itself is concerned with the differentiation and integration of the vector fields. Vector Calculus is often called multivariate calculus, although it has a slightly different study case. Multivariate calculus deals with calculus application functions of the multiple independent variables.

There are a few important terms I feel people need to know when starting learning the Vector Calculus, they are:

  • Derivative and Differentiation

The derivative is a function of real numbers that measure the change of the function value (output value) concerning a change in its argument (input value). Differentiation is the action of computing a derivative.

  • Partial Derivative

The partial derivative is a derivative function where several variables are calculated within the derivative function with respect to one of those variables could be varied, and the other variable are held constant (as opposed to the total derivative, in which all variables are allowed to vary).

  • Gradient

The gradient is a word related to the derivative or the rate of change of a function; you might consider that gradient is a fancy word for derivative. The term gradient is typically used for functions with several inputs and a single output (scalar). The gradient has a direction to move from their current location, e.g., up, down, right, left.

Probability and Distribution

Probability is a study of uncertainty (loosely terms). The probability here can be thought of as a time where the event occurs or the degree of belief about an event’s occurrence. The probability distribution is a function that measures the probability of a particular outcome (or probability set of outcomes) that would occur associated with the random variable. The common probability distribution function is shown in the image below.

Probability theory and statistics are often associated with a similar thing, but they concern different aspects of uncertainty:

•In math, we define probability as a model of some process where random variables capture the underlying uncertainty, and we use the rules of probability to summarize what happens.

•In statistics, we try to figure out the underlying process observe of something that has happened and tries to explain the observations.

When we talk about machine learning, it is close to statistics because its goal is to construct a model that adequately represents the process that generated the data.

Optimization

In the learning objective, training a machine learning model is all about finding a good set of parameters. What we consider “good” is determined by the objective function or the probabilistic models. This is what optimization algorithms are for; given an objective function, we try to find the best value.

Commonly, objective functions in machine learning are trying to minimize the function. It means the best value is the minimum value. Intuitively, if we try to find the best value, it would like finding the valleys of the objective function where the gradients point us uphill. That is why we want to move downhill (opposite to the gradient) and hope to find the lowest (deepest) point. This is the concept of gradient descent.

There are few terms as a starting point when learning optimization. They are:

  • Local Minima and Global Minima

The point at which a function best values takes the minimum value is called the global minima. However, when the goal is to minimize the function and solved it using optimization algorithms such as gradient descent, the function could have a minimum value at different points. Those several points which appear to be minima but are not the point where the function actually takes the minimum value are called local minima.

  • Unconstrained Optimization and Constrained Optimization

Unconstrained Optimization is an optimization function where we find a minimum of a function under the assumption that the parameters can take any possible value (no parameter limitation). Constrained Optimization simply limits the possible value by introducing a set of constraints.

Gradient descent is an Unconstrained optimization if there is no parameter limitation. If we set some limit, for example, x > 1, it is an unconstrained optimization.

Conclusion

Machine Learning is an everyday tool that Data scientists use to obtain the valuable pattern we need. Learning the math behind machine learning could provide you an edge in your work. There are many math subjects out there, but there are 6 subjects that matter the most when we are starting learning machine learning math, and that is:

  • Linear Algebra
  • Analytic Geometry
  • Matrix Decomposition
  • Vector Calculus
  • Probability and Distribution
  • Optimization

Critics:

Machine learning (ML) is the study of computer algorithms that improve automatically through experience and by the use of data. It is seen as a part of artificial intelligence. Machine learning algorithms build a model based on sample data, known as “training data“, in order to make predictions or decisions without being explicitly programmed to do so. Machine learning algorithms are used in a wide variety of applications, such as in medicine, email filtering, speech recognition, and computer vision, where it is difficult or unfeasible to develop conventional algorithms to perform the needed tasks.

A subset of machine learning is closely related to computational statistics, which focuses on making predictions using computers; but not all machine learning is statistical learning. The study of mathematical optimization delivers methods, theory and application domains to the field of machine learning. Data mining is a related field of study, focusing on exploratory data analysis through unsupervised learning. In its application across business problems, machine learning is also referred to as predictive analytics.

Machine learning approaches are traditionally divided into three broad categories, depending on the nature of the “signal” or “feedback” available to the learning system:

  • Supervised learning: The computer is presented with example inputs and their desired outputs, given by a “teacher”, and the goal is to learn a general rule that maps inputs to outputs.
  • Unsupervised learning: No labels are given to the learning algorithm, leaving it on its own to find structure in its input. Unsupervised learning can be a goal in itself (discovering hidden patterns in data) or a means towards an end (feature learning).
  • Reinforcement learning: A computer program interacts with a dynamic environment in which it must perform a certain goal (such as driving a vehicle or playing a game against an opponent). As it navigates its problem space, the program is provided feedback that’s analogous to rewards, which it tries to maximize.
